[TRTLLM-17146][feat] Add the Muse Spark Open decoder fast paths - #21356
The Muse Spark Open decoder's fast paths, on top of the model from #21042. The code comes from feat/musespark-open, where @brnguyen2 wrote it. #21042 kept only the reference composition; this PR adds the fused kernels the feature branch runs by default. Each one keeps the reference composition as its fallback for the inputs it does not support, and none needs a switch to turn it on.
Triton kernels (musespark_open_kernels.py), each next to a *_supported check that states the inputs it takes:
Post-expert norm and combine. The weight-first RMSNorm of each selected expert row, the routing weights and the top-k sum, in one kernel per token. A row behind an invalid slot (-1, or past the end of the expert output) is never read, so a NaN the MoE kernel left there cannot reach the sum.
Gated residual join.alpha * residual + beta * rmsnorm(gain * branch) over the FP32 residual stream, alone or together with the next branch's Gemma prenorm. It rounds to BF16 where the reference does.
Routing. For up to 128 tokens, sigmoid, bias, top-8 of 256 experts and the renormalized weights are one kernel. Its picks are sorted, with exact ties going to the lowest expert id, so the order in which the finalize sums the experts is fixed. Larger batches keep torch.topk and fuse only the weight renormalization.
Router projection. FP32 weights and accumulation for up to 128 tokens, with the input cast and the metap scale folded in; tensor cores (TF32x3) from 16 tokens.
Attention output norm and gate. The per-head weightless RMSNorm and sigmoid(gate) for up to 128 tokens, including the strided gate half of the fused QKV projection.
GB300 kernels (CuTe DSL):
Cluster boundary (musespark_open_boundary.py). For 1 to 32 tokens of the 8192-wide stream, a residual join and the next prenorm run across a CTA cluster that reduces both variances through distributed shared memory. Each decoder layer hands the next one its normalized attention input.
Fused finalize + all-reduce (musespark_open_finalize_ar.py). For BF16 TP4 with EP4 on one node and 1 to 128 tokens, the expert finalize and the TP all-reduce are one kernel, a one-shot exchange over CUDA IPC. Construction is collective: every rank either builds the workspace or raises the same error, and the model then keeps the unfused finalize and NCCL, with a warning. Release never frees memory a peer may still map.
Where they plug in.
The fused finalize + all-reduce runs inside the finalize the MoE registers as its unfinalized_combine_fn. MuseSparkOpenMoE.forward decides per call whether it applies, and then skips its own all-reduce. It applies only when the MoE will not split the batch into chunks.
Up to 128 tokens, the pooler and the pre-expert norm run on the auxiliary stream while the router and the routing run on the current one. The MoE joins them through ConfigurableMoE's input_ready_event.
For the native TRTLLM-Gen NVFP4 experts, the pre-expert norm is fused with the experts' input quantization (FlashInfer rmsnorm_fp4quant, unswizzled scales).
Numerics. The kernels round where the reference composition rounds, so they differ from it only in reduction order, plus the pre-expert quantization, which quantizes the FP32 norm result without the intermediate BF16 round. The tests bound each difference against the composition.
Not in this PR. The feature branch's opt-in experiments, each behind an environment switch, go to a separate performance effort: the TP8 fabric (MNNVL) finalize, sharded TP8 projections, prefill sequence parallelism, the low-latency QKV layout, the large-batch routing, finalize and norm/gate variants, the BF16x3 router and the FP32-residual pre-QKV norm. The feature branch's routing memo is gone: on main the MoE routes once and hands the finalize its weights.
Test Coverage
New one-GPU tests, added to the pre-merge block of l0_gb300.yml. Each checks a fused path against the reference composition, its fallbacks and CUDA graph replay with changed inputs:
test_musespark_open_router_projection.py
test_musespark_open_full_routing.py
test_musespark_open_norm_gate.py
test_musespark_open_moe_finalize.py
test_musespark_open_pre_expert_quant.py
test_musespark_open_moe_prepare_overlap.py
test_musespark_open_boundary_fusion.py, which includes the boundary carried across three layers
test_musespark_open_cluster_boundary.py, which needs GB300
test_musespark_open_finalize_local.py: the workspace's input checks and release order, without peers
New CPU tests, marked cpu_only:
test_musespark_open_fusion_switches.py: when the model builds the workspace, and the fallback when construction fails.
test_musespark_open_finalize_dispatch.py: the forward picks one finalize and reduces exactly once.
New four-rank tests, which spawn their ranks with MPIPoolExecutor. They are not in a CI list yet; they go into the GB300 multi-GPU list with the follow-up that registers the model's other multi-rank tests.
test_musespark_open_finalize_allreduce.py: parity with the unfused finalize plus NCCL, malformed calls and FP32 accumulation.
test_musespark_open_finalize_lifecycle.py: collective construction failures, close and drop, and the model's fallback.
test_musespark_open_finalize_stress.py: long, skewed and interleaved call sequences.
Changed: test_modeling_musespark_open.py checks the residual join bit for bit against the composition only off CUDA. On CUDA the join is the fused kernel, which test_musespark_open_boundary_fusion.py bounds against the composition.
On GB300, with a CI-built main wheel and this branch's Python:
The one-GPU and CPU files above, plus the existing Muse decoder tests: 340 passed, 7 skipped. The skipped tests are the MoE TP tests that need an external four-rank launch.
The four-rank files: 89 passed.
Logits on a 6-layer truncation of the checkpoint (TP1, text, image and audio prompts): the last-position logits have cosine similarity of at least 0.999 to main's reference paths.
trtllm-serve with the NVFP4 checkpoint at TP4/EP4, with the fused finalize + all-reduce active, and the same requests against main on the same day:
Every hard check passes on both, for text, math, image, video, speech and mixed requests. The weight accounting is complete.
Greedy responses differ from main token by token, as different rounding makes them. The answers do not change.
One soft check, on a pure tone, fails here and passes on main; the feature branch fails it too. The model reasons about whether it can hear the clip at all, so that answer is sensitive to small numeric changes.
Rebased onto main309426d, which moved to FlashInfer 0.7.2 ([None][chore] Update flashinfer-python from 0.6.18 to 0.7.2 #20911). With a CI-built main wheel from the same day, the results above are unchanged: 340 passed and 7 skipped on one GPU, 89 passed on four ranks, and every hard check of the serve smoke passes.
pre-commit passes on the changed files.

Dev Engineer Review
The change adds Triton paths for routing, router projection, attention normalization and gating, expert-input preparation, expert normalization and combination, and residual joins. Unsupported inputs retain reference paths.
On GB300, the change adds cluster-boundary fusion and a TP4 expert-finalize/all-reduce path. Verify workspace lifecycle, synchronization, and fallback behavior.
Decoder layers now accept precomputed attention input and an optional next-layer norm. Verify the layer-to-layer handoff and overlap synchronization.
Current review findings and independently verified test results were not supplied.
QA Engineer Review
The tests cover fused paths, dispatch, fallback behavior, CUDA graph replay, and finalize-workspace lifecycle. The GB300 CI list includes nine one-GPU Muse Spark Open test files. The supplied context reports that the four-rank finalize tests are not in a CI list. Coverage verdict: needs follow-up for CI coverage of the four-rank path.

Walkthrough
The decoder adds fused Triton and CuTe DSL paths for routing, attention gating, residual joins, MoE input preparation, and expert finalization. Model forward passes computed prenorm inputs between adjacent layers and selects fused TP4 finalize/all-reduce for eligible deployments. Reference paths remain for unsupported conditions.
Adds fused routing and routing-weight normalization, attention output normalization and gating, and expert normalization and combination. Tests compare fused results with references and cover fallback conditions.
Fuses supported residual joins with normalization, including a GB300 cluster path. Decoder forward passes a computed prenorm input to the next layer. Tests cover numerical results, graph replay, and unsupported inputs.
Adds fused router projection and eligible pre-expert NVFP4 preparation. For eligible CUDA batches, expert input preparation can run on an auxiliary stream while router logits are computed. The tests cover reference parity, readiness events, and fallback conditions.
TP4 fused finalize and all-reduce tensorrt_llm/_torch/models/modeling_musespark_open.py, tensorrt_llm/_torch/models/musespark_open_finalize_ar.py, tests/unittest/_torch/modeling/test_musespark_open_finalize_*, tests/unittest/_torch/modeling/test_musespark_open_fusion_switches.py
Adds an IPC workspace that combines expert normalization and routing weights with TP4 reduction. Model setup and MoE forward select the workspace for supported deployments and avoid a later reduction when finalize already reduced. Tests cover selection, parity, lifecycle, and failure paths.

Fallback tests compare the fallback path with itself.
In test_cluster_boundary_unsupported_shapes_keep_fallback and test_cluster_boundary_unaligned_contiguous_branch_keeps_fallback, actual and expected come from the same call: gate.add_after_rmsnorm_and_norm(...). The rtol=0, atol=0 comparison is always true. The unexpected stub does prove that cluster_boundary is not called. The tests do not check that the fallback output is correct. A wrong output from the Triton or composition path would pass.
Compute expected from the unfused composition. This is the same reference that test_boundary_fusion_preserves_residual_and_prenorm uses. Use the tolerances from that test.
Proposed fix (apply the same change at both sites)
Added files:test_musespark_open_boundary_fusion.py, test_musespark_open_cluster_boundary.py. test_modeling_musespark_open.py is modified; its join test is now CPU-only.
Behaviors covered: BF16 rounding, graph replay with live inputs, shape/alignment/empty-input rejection, side-stream and second-GPU use, and the three-layer prenorm carry.
Gap: the three-layer carry test uses hidden size 256. It does not run the 8192-wide cluster kernel through the model loop.
Test lists: I could not see l0_gb300.yml in the supplied context. Confirm that it lists the GB300-only cluster test file.
Verdict: needs follow-up. This is the fallback-assertion fix and the list check.

Compare the model's fused quantization with the expert reference.
The global-scale convention is already covered by the generic fused-kernel test. The Muse Spark test does not cover the model's direct rmsnorm_fp4quant(..., is_sf_swizzled_layout=False) call. It only checks type, layout, pointer pass-through, graph replay, and the cached gain. Add a model-path comparison against torch.ops.trtllm.fp4_quantize, with a small mismatch allowance for the skipped BF16 round.

Pass TOKENS and SIZE as runtime arguments.
TOKENS and SIZE are tl.constexpr parameters, so Triton can create a distinct specialization for each token count from 16 through 128. The two kernels can therefore require up to 226 specializations.
Both values are used only for pointer arithmetic and bounds masks. The kernels use fixed tl.arange ranges, tensor shapes, and loop bounds, so changing them to runtime arguments is valid.
The production caller can reach this path for supported CUDA inputs. No production precompilation covers every count in this range. The existing test covers selected counts and performs one call before graph capture, so an uncovered count can still incur first-use JIT latency.

Compile per token count causes first-use latency spikes.
_compile_boundary keys the cache on tokens. Each token count from 1 to 32 therefore triggers its own cute.compile, and the has_gain and eps values multiply that number. In the worst case, a serving process pays up to 64 compilations per device lazily on the forward path.
tokens only sets the launch grid (self.m * self.cluster). Only three configurations change the generated code (cluster = 16, 8 or 4). Pass the token count as a runtime Int32 argument. Then key the cache on cluster, has_gain and the eps values.
The CUDA graph path warms up before capture, so it is probably not affected. Eager decode batches that were not warmed still pay the compile cost.

The rounding and graph test can pass without running the cluster kernel.
expected comes from the fallback path. actual comes from add_after_rmsnorm_and_norm, and the cluster path is only one branch of it. Suppose cluster_boundary_supported returns False for these inputs, for example because of an alignment or dtype mismatch. Then actual and expected both come from the Triton fallback. Every bound passes, including the atol=0 eager-versus-graph check, and the CuTe kernel is never exercised.
Assert that the dispatch predicate accepts the inputs before the first call. Do the same in test_cluster_boundary_side_stream_and_gate_cache.

Fused kernels for the decoder's hot ops, each with the reference
composition kept as the fallback for the inputs it does not support:
- musespark_open_kernels: Triton kernels for the post-expert norm and
combine, the gated residual join (alone and with the next prenorm),
the routing weights, the full top-8 routing over 256 experts, the FP32
router projection, and the attention output norm and gate.
- musespark_open_boundary: a CuTe DSL kernel that splits a residual join
and the next prenorm across a CTA cluster (GB300, width 8192, 1 to 32
tokens).
- musespark_open_finalize_ar: the expert finalize fused with a one-shot
all-reduce over CUDA IPC (GB300, BF16 TP4 with EP4 on one node, 1 to
128 tokens). Construction is agreed across the TP group and falls back
to the unfused finalize and NCCL.
- The pre-expert norm fused with the experts' NVFP4 input quantization,
and small batches pool on the auxiliary stream while the router runs.
The four-rank tests spawn their ranks with MPIPoolExecutor; the

Description
The Muse Spark Open decoder's fast paths, on top of the model from #21042. The code comes from
feat/musespark-open, where @brnguyen2 wrote it. #21042 kept only the reference composition; this PR adds the fused kernels the feature branch runs by default. Each one keeps the reference composition as its fallback for the inputs it does not support, and none needs a switch to turn it on.Triton kernels (
musespark_open_kernels.py), each next to a*_supportedcheck that states the inputs it takes:-1, or past the end of the expert output) is never read, so a NaN the MoE kernel left there cannot reach the sum.alpha * residual + beta * rmsnorm(gain * branch)over the FP32 residual stream, alone or together with the next branch's Gemma prenorm. It rounds to BF16 where the reference does.torch.topkand fuse only the weight renormalization.sigmoid(gate)for up to 128 tokens, including the strided gate half of the fused QKV projection.GB300 kernels (CuTe DSL):
musespark_open_boundary.py). For 1 to 32 tokens of the 8192-wide stream, a residual join and the next prenorm run across a CTA cluster that reduces both variances through distributed shared memory. Each decoder layer hands the next one its normalized attention input.musespark_open_finalize_ar.py). Release never frees memory a peer may still map.Where they plug in.
unfinalized_combine_fn.MuseSparkOpenMoE.forwarddecides per call whether it applies, and then skips its own all-reduce. It applies only when the MoE will not split the batch into chunks.ConfigurableMoE'sinput_ready_event.rmsnorm_fp4quant, unswizzled scales).Numerics.
The feature branch's routing memo is gone: on
mainthe MoE routes once and hands the finalize its weights.Test Coverage

The tests cover fused paths, dispatch, fallback behavior, CUDA graph replay, and finalize-workspace lifecycle. The GB300 CI list includes nine one-GPU Muse Spark Open test files. The supplied context reports that the four-rank finalize tests are not in a CI list. Coverage verdict: needs follow-up for CI coverage of the four-rank path.
